What is a Validation Curve? Validation Curve Explained

A validation curve, also known as a model complexity curve, is a graphical tool used to evaluate the performance of a machine learning model across a range of different hyperparameter values. It helps in determining the optimal hyperparameter value that yields the best model performance.

The validation curve is typically created by plotting a performance metric, such as accuracy or mean squared error, on the y-axis against different values of a hyperparameter on the x-axis. The performance metric is computed using cross-validation, where the dataset is divided into training and validation sets multiple times, and the average performance is calculated.

The purpose of the validation curve is to analyze how the performance of the model changes as the hyperparameter value varies. It helps in understanding the impact of different hyperparameters on the model’s ability to generalize well to unseen data. By examining the validation curve, one can identify if the model is underfitting (high bias) or overfitting (high variance) and make informed decisions about selecting the appropriate hyperparameter value.

The validation curve typically exhibits the following patterns:

Underfitting: When the hyperparameter value is too low, the model may have limited complexity, resulting in poor performance on both the training and validation sets. The performance metric is low and relatively constant across different values of the hyperparameter.

Optimal Value: There is a range of hyperparameter values where the model achieves the best performance. The validation curve exhibits a peak or plateau at this optimal value, indicating that the model is well-calibrated and balanced in terms of bias and variance.

Overfitting: When the hyperparameter value is too high, the model becomes overly complex, leading to overfitting. The model performs exceptionally well on the training set but fails to generalize to the validation set. The validation curve shows a decline in performance as the hyperparameter value increases.
